Successful approach:

  1. Identify specific, measurable business problems
  2. Evaluate AI as potential solution
  3. If AI fits, implement with clear success criteria
  4. Measure, iterate, expand

Failed approach:

  1. “We should use AI more”
  2. Find some use cases
  3. Implement without clear success criteria
  4. Struggle to demonstrate value

Pattern 2: Embedded Over Centralized

The AI center of excellence model—centralized team handles all AI—fails at scale. The successful model is embedded: central team provides enablement and standards, but AI capability lives in business teams.

Central team responsibilities:

  • Platform and infrastructure
  • Standards and best practices
  • Training and enablement
  • Complex project support
  • Governance and compliance

Business team responsibilities:

  • Identifying use cases
  • Owning implementations
  • Managing daily operations
  • Gathering feedback for improvement

Pattern 3: Governance Before Scale

Organizations that implement governance frameworks before scaling AI achieve more sustainable outcomes.

Governance components:

  • Use case approval process
  • Data handling requirements
  • Model validation standards
  • Monitoring and audit requirements
  • Escalation paths

Rushing to deploy AI without governance creates technical debt that slows future progress.

Pattern 4: The Hybrid Approach to Building

Organizations trying to build everything internally or buy everything fail. The successful approach is hybrid.

What to build:

  • Differentiating capabilities unique to your business
  • Proprietary data processing and insights
  • Integration with internal systems

What to buy:

  • General AI capabilities (foundation models, standard tools)
  • Infrastructure components
  • Non-differentiating supporting functions

What to partner on:

  • Complex implementations requiring expertise
  • Emerging technologies not yet mature

Common Failure Modes

Failure Mode 1: Pilot Purgatory

Organizations run successful pilots but never move to production. The transition from pilot to production requires different capabilities—infrastructure, governance, operational expertise—that pilots don’t develop.

Breaking out:

  • Design pilots with production in mind from start
  • Require production path before approving pilots
  • Allocate production resources alongside pilot resources

Failure Mode 2: Data Debt

AI systems trained on poor data produce poor results. Organizations with decades of accumulated data mess discover that their AI initiatives reveal how unusable their data is.

Addressing debt:

  • Data quality assessment before AI initiatives
  • Invest in data quality as prerequisite to AI
  • Set realistic timelines for data-dependent AI

Failure Mode 3: Skipping the Basics

Organizations want to implement cutting-edge AI while their basic data infrastructure, change management, and technical debt remain unaddressed.

Fundamentals first:

  • Clean, accessible data
  • Basic cloud infrastructure
  • API integration capabilities
  • Change management capacity

Cutting-edge AI on broken foundations produces broken results.

Failure Mode 4: The Proof of Concept Trap

Endless proof of concepts without production deployment. Organizations become comfortable in experimentation mode and avoid the harder work of production.

Breaking the pattern:

  • Time-box proof of concepts strictly
  • Require decision to productionize or abandon after POC
  • Celebrate production deployment, not just POC completion

Change Management Considerations

The Trust Problem

Employees don’t trust AI systems they don’t understand. They especially don’t trust AI systems that might affect their jobs.

Building trust:

  • Transparent about what AI can and can’t do
  • Involve employees in AI design, not just implementation
  • Clear communication about how AI affects roles
  • Include employee concerns in planning

The Change Curve

Organizations move through predictable stages:

  1. Experimentation: Everyone wants to try AI
  2. Validation: “Does this actually work?”
  3. Frustration: “This is harder than expected”
  4. Optimization: “How do we make this work better?”
  5. Normalization: “AI is part of how we work”

Understanding this curve helps leaders manage expectations and persist through the difficult middle stages.

Structure

AI Center of Excellence typically includes:

  • Leadership (strategy, governance, ROI)
  • Platform Team (infrastructure, tools, standards)
  • Data Science Team (model development, evaluation)
  • ML Engineering Team (production deployment, monitoring)
  • Enablement Team (training, documentation, support)
  • Domain Teams (embedded AI specialists in business units)

Key Responsibilities

Platform Team: AI infrastructure, tool selection and standardization, security and compliance frameworks, cost management.

Data Science Team: Use case identification, model development, algorithm selection, experimental design.

ML Engineering Team: Model deployment, monitoring, performance optimization, production issue resolution.

Enablement Team: Training programs, documentation, community building, support and consultation.
